We live in a world increasingly shaped by technology. A recent study by Exploding Topics, a website that analyzes data trends, revealed a statistic, showing that 77% of companies are either currently using AI or actively exploring its potential applications in their businesses. 

Decisions that were once made by humans, such as loan approvals and criminal justice judgments, are now often guided by artificial intelligence (AI) systems. These algorithms, trained on large datasets, have the potential to simplify processes and enhance efficiency. 

However, a crucial question remains, can we trust these systems to be fair?

Unfortunately, biased data, algorithmic choices, and even human influence can all contribute to AI maintaining unfair and discriminatory outcomes. The concern lies in the potential for bias to infiltrate AI at various stages. The data used to train these systems, as well as the algorithms themselves, can introduce biases that lead to unfair outcomes.

By understanding how AI bias can work, can we identify the root cause of the potential rejection? Can we build fairer AI systems that ensure everyone has an equal shot at a loan approval, or any other decision impacted by AI?

This article explores the ethical considerations surrounding AI and examines strategies to mitigate bias within these systems, ensuring their benefits reach all members of society equitably.

Case studies in AI ethics and bias mitigation

The human cost of bias in AI is very important, impacting individuals opportunities and harming trust in institutions. As AI continues to integrate into our lives, addressing bias is not just a technical challenge, but an ethical imperative.

These are some of the real-world examples of how AI bias plays out, highlighting the human cost and its impact on society in general.

Loan denials and missed opportunities

One area where bias in AI systems can have important impacts is in the realm of loan approvals and denials. Research at UC Berkeley Haas School of Business has shown that AI algorithms used by financial institutions to assess loan applications may accidentally sustain biases, particularly against marginalized groups. 

For example, studies have found that these algorithms may be more likely to deny loans to individuals from certain racial or ethnic backgrounds, even when they have similar financial profiles to applicants from other groups.

Imagine a young entrepreneur with a fantastic business idea. They carefully put together a loan application, a document filled with their goals and financial plans. This impressive work reaches the decision-maker – a cold, emotionless AI system that analyzes everything with strict logic. But disappointment sets in as the system stumbles, its answer a disappointing “no.”

Why this unexpected rejection? Studies suggest that AI loan approval systems trained on past information might continue existing racial biases. This can lead to situations where loans are unfairly denied to qualified individuals based on their ethnicity, making it harder for them to achieve their financial goals and keeping economic inequalities alive.

Countless individuals face similar rejections, their dreams and ambitions crushed by an AI system that repeats past unfairness.

Criminal justice

This can also happen in the criminal justice system, where biases in AI algorithms may unfairly influence decisions, leading to unequal treatment.

We have one such example in the story, where Brisha Borden and her friend attempted to ride a kid’s bike and scooter they found unlocked, only to be caught by the owner. They dropped the items but were arrested, charged with burglary and petty theft. 

Meanwhile, Vernon Prater, a seasoned criminal, was caught shoplifting tools. Despite Borden’s clean record and Prater’s criminal history, an algorithm labeled Borden, who is black, as high risk and Prater, who is white, as low risk.

Two years later, the woman stayed clean, while the man committed a bigger crime. The algorithm got it wrong.

The hiring trap

The increasing use of AI in applicant screening for jobs presents a novel challenge. These systems often rely on keywords to identify qualified candidates. While this can streamline the initial selection process, it can also lead to unintended consequences. 

Resumes that are well-crafted but lack the specific keywords the AI prioritizes may be filtered out, unfairly disadvantaging otherwise qualified individuals. 

Consider, for example, a scenario where a candidate with a demonstrably strong track record in their field submits a compelling resume. However, their resume lacks the specific keywords the AI system is searching for. 

As a result, their application may be disqualified before a human recruiter even has the opportunity to assess their potential. This creates a selection process that inadvertently prioritizes keyword optimization over demonstrably strong skills and experience, where candidates who understand how to tailor their resumes for AI gain an advantage over equally qualified candidates who may not possess the same familiarity with the technology. 


Bias can also infiltrate healthcare decisions, impacting patient treatment and health outcomes. For instance, implicit biases, where healthcare providers hold unconscious stereotypes about certain groups, can influence everything from communication styles to diagnoses. 

A patient’s race, gender, socioeconomic background, or even weight can lead to assumptions that affect the care they receive. This can result in missed diagnoses, delayed treatment, or even inadequate pain management for certain groups. 

Facial recognition bias

Facial recognition technology, a subset of computer vision in AI, facilitates computers in interpreting and comprehending visual data, particularly human faces, within images or videos. 

This technology has widespread applications across many sectors, including surveillance and home security systems, facial recognition software, object tracking systems, and medical image analysis for early disease detection. 

By analyzing facial features, such as the arrangement of eyes, nose, and mouth, facial recognition algorithms can identify individuals or verify their identities, enhancing security measures and streamlining various processes. 

However, it is crucial to acknowledge that facial recognition systems can be susceptible to biases, particularly when trained on data sets that lack diversity in terms of ethnicity, age, gender, or other factors. These biases can lead to inaccuracies or disparities in recognition rates, potentially resulting in discriminatory outcomes. 

Essentially, these case studies highlight the critical importance of addressing bias in AI systems across various domains. The human cost of bias in AI is huge, impacting individuals opportunities and harming trust in institutions.

We need an approach that combines technical solutions with ethical considerations and a commitment to building fairer systems. This is not just about creating better algorithms, it’s about building a future where AI empowers everyone, not just a select few. 

By actively mitigating bias, we can ensure that AI becomes a tool for progress, not a barrier to opportunity.

How bias works in AI?

Understanding how bias works and its various forms is crucial for building fairer and more ethical AI systems. It’s important to know that bias in AI doesn’t arise from a single source, but can infiltrate at various stages of development and use.

Here are most common types:

  • Algorithmic bias – This occurs when the design choices made by developers introduce inherent biases into the algorithms themselves. For example, an algorithm tasked with facial recognition might be more accurate in identifying faces of a particular race due to the data used for training.
  • Data bias – If the data, used to train AI models, contains historical biases, the AI model will learn and perpetuate those biases. Imagine a loan approval system trained on past data that favored male applicants. It might continue to disfavor female applicants with equally strong financial profiles.
  • Selection bias – This arises when the data chosen to train the AI model is not representative of the real world. The spam filter trained only on emails flagged by users, might become overly aggressive, flagging legitimate emails because it hasn’t been exposed to the full spectrum of emails.
  • Interaction bias – This bias emerges during the interaction between users and AI systems. For example, if a voice assistant consistently misinterprets a particular accent, it can lead to frustration and a negative user experience, potentially discouraging users from that particular technology.

Sources of bias

While historical bias remains a concern, the nature of AI bias is continually changing.

Representation bias is becoming a bigger problem, especially with the rise of facial recognition. Training data mostly showing lighter-skinned individuals can make it harder for people of color to be recognized accurately.

Moreover, measurement bias can come from small differences in how data is labeled. For example, an AI system looking at loan applications might misunderstand payment history data because of differences in how different lenders report it.

Finally, cognitive bias, where developers own unconscious biases influence the design of AI systems, is still a worry. Here, diverse development teams and ongoing bias awareness training are crucial to mitigate the impact of these internal biases.

The ethical imperative of AI

One of the core ethical concerns in AI is transparency. AI systems, especially those based on complex models like deep learning, often operate as “black boxes,” making it difficult to understand how they arrive at specific decisions. 

Transparency involves making AI operations clear and understandable to users and stakeholders. Explainability, a subset of transparency, refers to the ability to explain how AI models make decisions. This is crucial for trust, especially in sensitive applications such as healthcare or criminal justice.


Accountability in AI includes developers, implementers, and users all being responsible for ensuring proper AI function, addressing unintended consequences, and mitigating errors, biases, and potential harm.

Fairness and non-discrimination

AI systems must be designed and trained to avoid discrimination and ensure fairness, by addressing biases in data and algorithms that can lead to unfair treatment of individuals or groups based on race, gender, socioeconomic status, or other characteristics. 

Privacy and data protection

AI systems often require vast amounts of data to function effectively, raising significant privacy and data protection concerns. Ethical AI must prioritize the protection of individuals data, ensuring that it is collected, stored, and used in ways that respect privacy and comply with legal standards such as the General Data Protection Regulation (GDPR).

Social and environmental impact

When we use AI, it can have big effects on society and the environment. Good AI development thinks about these wider impacts, like job losses, how it affects the planet, and how it affects people as a whole. Responsible AI should aim to make things better for society and avoid any bad consequences.

Bias mitigation strategies

Fighting these biases requires several strategies:

Diverse development teams

Diverse development teams bring a wealth of perspectives and experiences to the table. This is crucial because AI systems are only as good as the data they’re trained on. If the team is homogenous, there’s a higher risk of prolonging existing biases within the data or overlooking potential ethical considerations. Incorporating people from different backgrounds, ethnicities, genders, and areas of expertise ensures a better understanding of the real world and the potential impacts of AI. 

Data scrutiny

The cornerstone of successful Artificial Intelligence (AI) development lies in the rigorous examination of the data used for training, a process similar to careful scientific analysis. This data scrutiny is essential as it safeguards against the incorporation of biases or inaccuracies that could lead to unreliable and potentially unfair AI systems. The process involves a systematic review of the data for errors, inconsistencies, and most importantly, biases. These biases can be introduced during data collection, labeling, or may even reflect existing societal prejudices. Through data scrutiny, such biases can be identified and mitigated on time.

Algorithmic transparency

Algorithmic transparency emphasizes the need for clarity and understandability in the inner workings of AI systems. This doesn’t necessarily mean revealing every intricate detail of the algorithm, but rather providing a sufficient level of explanation about how the system arrives at its decisions. Transparency fosters trust by allowing users and developers to understand the rationale behind the AI’s outputs. Furthermore, it empowers stakeholders to identify and address potential biases within the algorithm or the data used to train it. 

Fairness metrics

Fairness metrics act as quantifiable measures that assess the degree of fairness exhibited by an AI system. They typically compare the performance of the AI model across different subgroups, such as demographics or socioeconomic backgrounds. Common fairness metrics include metrics for equality of opportunity, ensuring everyone has a fair chance of receiving a positive outcome and disparate impact to avoid situations where one group is disadvantaged by the AI’s decisions. 

Human oversight

Human oversight ensures that AI systems are used responsibly and in accordance with ethical principles. This can involve tasks like monitoring the AI’s outputs for bias or errors, intervening when necessary to override or adjust its decisions, and ensuring the system is used for its intended purpose. Effective human oversight requires clear lines of responsibility, well-defined protocols for intervention, and ongoing training for those overseeing the AI system.

Explainable artificial intelligence

As mentioned earlier, traditional AI models often operate as “black boxes.” We are able to see the input and the output, but the complex calculations that lead to the final decision remain a mystery. This lack of transparency hinders trust and can perpetuate biases hidden within the data used to train the model.

This is where explainable AI (XAI) steps in. XAI is a collection of techniques that clarify AI models, making their internal reasoning processes clearer and more interpretable. By employing XAI, we can gain valuable insights into how these models arrive at their conclusions.

This can be done through methods like Local Interpretable Model-Agnostic Explanations (LIME) which analyze the model’s reasoning behind a specific prediction. Additionally, XAI can limit the decision-making pathways of the AI or focus on educating users on how the AI arrives at its outputs. 

Ultimately, XAI helps us understand the “why” behind AI decisions, fostering trust and enabling adjustments when needed.

Regulatory and policy considerations

Regulations aim to mitigate risks and ensure AI development and deployment adheres to ethical principles. They can provide frameworks for data collection, storage, and usage, promoting responsible data practices and protecting user privacy. Additionally, regulations can establish standards for transparency and explainability in AI algorithms.

While regulation is necessary, it’s crucial to strike a balance. Overly restrictive regulations can limit innovation and obstruct the development of beneficial AI applications. Therefore, regulatory frameworks need to be adaptable to keep pace with the AI technology advancements.

The regulation of AI requires cooperation from various stakeholders, each playing a very important role in ensuring a responsible AI future.


Governments are well-positioned to establish the ethical foundation for AI development and deployment. One key strategy involves creating national or regional AI principles that outline high-level expectations for responsible AI practices.

For example, the European Union (EU) has developed its “Ethics Guidelines for Trustworthy AI” highlighting principles such as human-centricity, fairness, and explainability. These principles navigate companies and organizations developing AI systems, guiding them towards ethical considerations throughout the entire development process.

National and regional governments can also develop specific AI regulations to translate principles into action. 

Examples of government initiatives:

  • The European Union (EU) – The EU’s proposed Artificial Intelligence Act (AIA) takes a risk-based approach, categorizing AI systems based on their potential risks and imposing stricter regulations on high-risk systems.
  • The United States (US) – The US has adopted a more sector-specific approach. Agencies like the Federal Trade Commission (FTC) are focusing on AI regulation in areas like consumer protection and algorithmic bias.
  • Singapore – The Singapore Model Governance Framework provides a voluntary set of guidelines for ethical AI development, promoting responsible innovation while avoiding overly restrictive regulations.

The global nature of AI development necessitates international cooperation on ethical frameworks. Governments across the globe can work with international organizations to create harmonized AI principles and foster collaboration on regulatory best practices.

International Organizations

International organizations, established by agreements between multiple countries, are suitable to bridge divides. These formal institutions, with defined memberships, clear objectives, and permanent staff, can facilitate dialogue and collaboration among countries with diverse political and economic interests. 

One key strategy they employ is developing global AI principles. These principles serve as a guiding light for governments and companies worldwide, providing a framework for ethical AI development and deployment.

Several international organizations are important in AI ethics, but some are especially notable for their specific focus and broad influence:

  • Organization for Economic Co-operation and Development (OECD) – The OECD has been at the forefront of developing international AI principles. Their “AI Principles” document, adopted by over 40 countries, provides a foundational framework for ethical AI development.
  • United Nations Educational, Scientific and Cultural Organization (UNESCO) – UNESCO have a unique approach, focusing on the cultural aspects of AI ethics. Their “Recommendation on the Ethics of Artificial Intelligence“, adopted by all 193 member states, emphasizes cultural diversity and inclusivity in AI development.
  • The United Nations (UN) – The UN are exploring the development of a global framework for responsible AI based on human rights principles, and various UN agencies address specific AI-related issues like labor and security.
  • World Health Organization (WHO) – The WHO is concerned with the ethical implications of AI in healthcare, particularly regarding data privacy and algorithmic bias in medical decision-making.
  • International Telecommunication Union (ITU) – The ITU focuses on the telecommunications infrastructure that underpins AI systems, by developing standards and best practices for ensuring responsible AI development within this critical technological domain.

The Private Sector

Leading companies understand that ethical AI practices mean more than just following rules. By embracing strong ethical guidelines throughout the AI development process, companies can build trust with users, reduce risks, and gain a lasting competitive edge.

Here are some of the companies taking the lead with their ethical standards:

  • Google – Google AI focuses on the importance of social benefits, fairness, responsibility, safety, and human supervision in AI development. They openly commit to not developing applications for weapons or technologies that violate human rights. Additionally, Google AI invests in research on fairness and bias in AI and provides tools and resources to developers for creating more inclusive algorithms.
  • Microsoft – Microsoft’s AI emphasizes the importance of human-centered AI design. Company established an internal ethics board to review AI projects and has taken steps to ensure responsible use of facial recognition technology.
  • IBM – IBM offers tools and services to help developers build explainable AI models and mitigate bias in datasets, with focus on building trust in AI by ensuring its explainability and user control over data.
  • Facebook (Meta) – Meta has established an independent AI oversight board and is investing in research on responsible AI development. Their AI principles emphasize the need for ongoing dialogue about the societal implications of AI.


Universities and research institutions are continuously seeking knowledge to address pressing ethical issues as the technology rapidly advances. 

Consequently, researchers are not only developing methods to ensure key ethical principles are embedded in AI, but also taking responsibility for educating future generations on its responsible use.

Universities offer courses, workshops, and even degree programs focused on AI ethics. These programs equip students with a comprehensive understanding of the ethical dimensions of AI technology. By integrating ethics into the syllabus, universities cultivate a culture of responsibility among future AI developers and researchers.

Through research, education, and collaboration, academia represents a very important factor contributing to AI ethics.

Civil society organizations

Civil society organizations (CSOs) safeguard against algorithmic bias and advocate for data privacy regulations. 

Besides guarding against potential harms, CSOs promote ethical AI applications that address societal challenges, such as climate change and healthcare disparities. For instance, they may support using AI to improve the distribution of renewable energy or to create diagnostic tools that enhance healthcare access in underserved regions.

Finally, they enable dialogue between governments, corporations, and academia to ensure that AI governance reflects diverse perspectives and ethical considerations. By fostering discussion and teamwork, CSOs ensure that AI governance considers a variety of viewpoints and ethical concerns. 

Ways you can help ensure responsible AI usage

The first step in ensuring AI’s responsible use is to stay informed. By taking time to learn about AI ethics through articles, documentaries, or online courses, you equip yourself to become a voice for responsible use. Furthermore, keeping up with new developments and ethical discussions through trustworthy sources allows you to understand the world of AI.

Besides knowledge, being a responsible user is crucial. When using AI-powered systems, be aware of potential biases in things like search engines, social media algorithms, or loan applications. If you notice bias, don’t hesitate to report it to the developers or platform owners. 

It’s also essential to ask for clarity. Advocate for companies and organizations to be transparent about how they use AI and the data they collect. Look for information on their websites or directly inquire about their AI development practices. 

Whenever possible, choose products and services from companies that prioritize ethical AI development, as shown by published AI ethics principles or established oversight boards.

Finally, let your voice be heard. Engage in conversations about AI ethics with friends, family, and colleagues, encouraging them to become informed users as well.

Keep in mind that we all have a part to play in influencing AI’s future. By asking for transparency, supporting ethical guidelines, and backing responsible AI development, we can ensure AI benefits humanity in the best possible way.
